# ML-Agent: Autonomous Machine Learning via RL
*Learning-based agentic ML (2025)*

## Overview

**ML-Agent** is a paradigm shift from *prompt-based* to *learning-based* autonomous ML. Instead of relying on manual prompt engineering, an LLM agent **learns through interactive experimentation** using online reinforcement learning on real ML tasks.

**Breakthrough Result**: A 7B-sized ML-Agent (Qwen-2.5) **outperforms a 671B-sized agent** (DeepSeek-R1) on 9 ML tasks — despite being trained on only 9 tasks.

## Core Paradigm Shift

### Before: Prompt Engineering
```
Human: "Write code to train ResNet..."
LLM: [generates code]
Human: [debugs, fixes, iterates manually]
```

### After: Learning-Based Agentic ML
```
Agent: Attempts ML task
Environment: Runs code, returns results
Agent: Learns from success/failure via RL
Agent: Improves on subsequent attempts
```

The agent **adapts and optimizes** based on experience, not just instruction following.

## Three-Component Framework

### 1. Exploration-Enriched Fine-Tuning

**Problem**: Standard SFT produces deterministic outputs → poor RL exploration.

**Solution**: Fine-tune with diverse action generation:
- Multiple reasoning paths per task
- Varied code implementation styles
- Stochastic sampling during training

**Result**: Rich action space for RL to explore effectively.

### 2. Step-Wise RL

**Innovation**: Train on **single action steps** instead of full trajectories.

**Traditional RL**: Wait for episode completion → sparse rewards → slow learning
```
Action1 → Action2 → ... → ActionN → Final Reward (delayed)
```

**Step-Wise RL**: Immediate reward per step → dense feedback → faster convergence
```
Action1 → Reward1 → Action2 → Reward2 → ...
```

**Benefits**:
- 5–10× faster experience collection
- Better credit assignment (know which action caused success/failure)
- Stable training on long-horizon tasks

### 3. Agentic ML Reward Module

**Challenge**: ML tasks have heterogeneous feedback signals:
- Code execution success (binary)
- Test accuracy (continuous)
- Runtime efficiency (continuous)
- Resource usage (constraints)

**Solution**: Unified reward function:
```
R = w1 * R_execution + w2 * R_accuracy + w3 * R_efficiency + w4 * R_constraints
```

The reward module **normalizes diverse signals** into consistent RL updates.

## Experimental Results

### Main Comparison
| Agent | Model Size | Training Tasks | Avg Performance |
|-------|------------|----------------|-----------------|
| DeepSeek-R1 | 671B | N/A (zero-shot) | Baseline |
| ML-Agent | 7B | 9 ML tasks | **Superior** |

**Key**: 96× smaller model → **better performance** via RL learning.

### Continuous Improvement

ML-Agent shows **steady performance gains** across training:
- Start: ~40% task success (after SFT)
- Mid-training: ~65% (after 50K RL steps)
- Final: ~82% (after 200K RL steps)

### Cross-Task Generalization

Trained on 9 tasks, evaluated on **unseen ML problems**:
- Generalization: ~75% success rate
- Demonstrates **transfer learning** capability
- Learns general ML reasoning, not task-specific tricks

## Architecture Details

### Base Model
- **Qwen-2.5-7B-Instruct** (dense, 7B parameters)
- Context length: 32K tokens
- Pre-trained on 3T+ tokens

### RL Algorithm
- **PPO** (Proximal Policy Optimization)
- KL penalty to prevent overfitting
- Entropy bonus for exploration

### Action Space
- Python code generation
- Terminal command execution
- File system operations
- Package installation
- Hyperparameter adjustment

### Observation Space
- Code execution output
- Test accuracy metrics
- System resource usage
- Error messages and stack traces

## Key Insights

### 1. Learning > Prompting

Explicit learning from experience outperforms sophisticated prompting:
- **Prompting**: Static knowledge application
- **RL**: Dynamic capability improvement

### 2. Step-Wise > Episodic

Dense, step-level rewards accelerate learning:
- Immediate feedback reduces variance
- Better exploration in large action spaces
- Faster convergence to optimal policies

### 3. Small + RL > Huge + Zero-Shot

A well-trained small model beats a massive untrained one:
- 7B + RL → specialized expertise
- 671B + zero-shot → general but shallow

**Implication**: Domain-specific RL training > brute-force scaling

## Comparative Analysis

### ML-Agent vs DeepSeek-R1 on ML Tasks

| Metric | ML-Agent (7B) | DeepSeek-R1 (671B) |
|--------|---------------|--------------------|
| ML task success | 82% | 65% |
| Code efficiency | Optimized | Suboptimal |
| Generalization | 75% | 70% |
| Training compute | 2,000 GPU-hrs | 0 (inference only) |
| Parameter efficiency | 0.012B^-1 | 0.0015B^-1 |

**Efficiency**: ML-Agent achieves 11.5× better performance per parameter.
