U-Mind: Unified Framework for Real-Time Multimodal Interaction

Core Problem

Building an intelligent, fully interactive agent requires generating coherent multimodal outputs combining high-level reasoning with expressive body motion, speech, and video. Existing systems have critical limitations:

  • Unimodal generation: Models handle text OR speech OR motion, not all simultaneously
  • Degraded reasoning: Joint training on multimodal data often destroys the LLM's original planning and dialogue capabilities (catastrophic forgetting)
  • Poor cross-modal alignment: Lack of token-level alignment across modalities impairs temporal and semantic coordination
  • No real-time loop: No system unifies reasoning, synchronized generation, and video rendering in a real-time interactive framework

Technical Solution

Architecture: LLaMA2-7B Backbone with Unified Token Space

Built on LLaMA2-7B, extended to a unified multimodal framework via discrete token representations:

Motion Representation: - SMPL-X body model → 6D joint rotations - Residual Vector Quantized VAE (RVQ-VAE) discretizes motion into latent tokens - Enables autoregressive modeling over temporally structured body dynamics

Speech Representation: - RVQ-VAE from SpeechTokenizer - Captures both semantic content and paralinguistic cues (prosody, emotion)

Special Reasoning Tokens: - ⟨think⟩ and ⟨/think⟩ delimit internal Chain-of-Thought segments - Speech, motion, and reasoning segments wrapped with start/end tokens - All modalities share a unified embedding space → next-token prediction across all

Two-Stage Training Paradigm

Stage 1: Rehearsal-Driven Foundational Pre-training

Balances two competing objectives: 1. Modality grounding tasks: T2M (text-to-motion), S2M (speech-to-motion), T2S (text-to-speech) — learn new modalities 2. Rehearsal tasks: Pure-text reasoning data (OpenOrca) — preserve LLM's planning/dialogue abilities

Segment-wise alignment strategy: Segments inputs by prosodic boundaries (rhythm, pauses), trains on randomized compositions to enhance fine-grained temporal synchrony.

This joint training achieves cross-modal alignment without compromising reasoning.

Stage 2: Instruction Tuning with Text-First Decoding

Supervised fine-tuning on diverse dialogue and task prompts. Each response follows:

⟨think⟩ internal CoT plan ⟨/think⟩ → text → acoustic tokens → motion tokens

The text-first decoding ensures symbolic reasoning takes precedence before generating continuous modalities.

Real-Time Inference Pipeline

Evaluated on BEAT v2 (S2M) and HumanML3D (T2M) datasets: - 10K S2M and 16K T2M sentence-level samples with QA triplets from Qwen3 - Achieves state-of-the-art across: - High-level question answering - Complex instruction execution - Text-to-motion (T2M) generation - Speech-to-motion (S2M) generation

The model maintains strong reasoning performance while generating synchronized multimodal outputs.
